Machine learning techniques unveiled 

The machine learning methodologies discussed here collectively aim to alleviate limitations posed by sparsely labeled or even unlabeled data, enhancing the adaptability and versatility of machine learning models with minimal training instances. Each machine learning technique possesses distinct strengths tailored to address specific requirements and resource availability across various contexts. 

Let's start with zero-shot learning. 

Zero-Shot Learning: (ZSL) Zero-shot learning in machine learning refers to training models without explicit exposure to labeled data for a specific task. Unlike traditional models, which require substantial labeled data for each task, zero-shot learning enables models to generalize and make predictions on new tasks with minimal or no task-specific examples. In ZSL, class naming in the output is guided by semantic attributes associated with the class, allowing models to understand semantic relationships between attributes and classes. 
 

Here's how ZSL typically works: 

• Semantic Representation: Each class is associated with semantic attributes describing its characteristics. 
• Attribute Prediction: The model predicts attributes for unseen classes based on their semantic representation. 
• Naming Based on Attributes: Predicted attributes generate a name or label for unseen classes. 
• Confidence Score: The model may provide a confidence score or probability distribution for predicted attributes. 
• Output: The model outputs the predicted class name and associated confidence score. 

The image below provides a simplified step-by-step walkthrough of ZSL:  

Step-1 Data Collection: Collect a dataset containing images of various dog breeds, excluding Dalmatians.  

Step-2 Data Preprocessing: Preprocess the images, including resizing, normalization, augmentation, etc.  

Step-3 Model Training: Define classes and train a machine learning model using the labeled dataset. At this stage, the model learns to recognize different dog breeds except for Dalmatians. 

Step-4 Inference with Zero-Shot Learning: Deploy the trained model for inference. When presented with an image of a Dalmatian during inference, the model uses zero-shot learning to classify it correctly, despite never having seen a Dalmatian during training. 

Step-5 Classifying Unseen Class: The model leverages semantic information or attributes associated with Dalmatians (such as "spotted coat" or "medium size") to make predictions. Since the model has learned to generalize across different dog breeds, it can recognize Dalmatians as a new, unseen class based on shared attributes learned during training. 

In this guided example, zero-shot learning demonstrates its ability to classify unseen classes like Dalmatians by leveraging shared attributes learned during training. This approach expands the model's capabilities beyond its training data. Zero-shot learning is beneficial when obtaining labeled data for every task is impractical or costly, enabling models to handle a broader range of tasks without explicit training data. 

Other concepts, similar to zero-shot learning, introduce alternative approaches, which we'll briefly discuss below. 

One-shot learning: During one-shot learning, a model is trained to perform a task using only a few examples per class. The goal is to enable the model to generalize and make accurate predictions on new instances with minimal training data. One-shot learning is useful in scenarios where obtaining a large amount of labeled data, such as in medical imaging or certain specialized domains, is challenging. 

Few-shot learning: Few-shot learning is a broader concept encompassing both one-shot learning and scenarios where a small number of examples (more than one) are available per class during training. It aims to train models that can perform well with limited labeled data. 

Transfer learning: Involves pre-training a model on a large dataset for a related task and then fine-tuning it on a smaller dataset for the target task. The knowledge gained during the pre-training phase is transferred to the new task. When there is not enough labeled data for a specific task, transfer learning can help by using knowledge gained from a broader range of tasks.

Meta-learning: Meta-learning, or learning to learn, involves training a model to quickly adapt to new tasks with minimal examples. The model is exposed to a variety of tasks during training, allowing it to learn generalizable patterns. One popular approach in meta-learning is to use recurrent neural networks or neural architectures that can efficiently capture and reuse learned knowledge across different tasks. 

Self-supervised learning: Self-supervised learning trains models on input data without relying on external labels. The model learns to create its own supervision signals during training. Techniques such as word embeddings, contrastive learning, and pretext tasks in natural language processing are forms of self-supervised learning.
